The architecture is modular, enabling the integration of various micro models and sub-micro models. This design ensures flexibility, allowing for the addition of new models or the customization of existing ones as the Web3 landscape evolves.
Major Components:
Data Ingestion Layer: Responsible for collecting and normalizing data from both on-chain and off-chain sources. Examples include blockchain transactions, smart contract data, market trends, social media sentiment, and user interactions.
Feature Engineering Layer: Processes raw data into features suitable for predictive modeling. For instance, in the context of DeFi, this might involve calculating loan-to-value ratios, tracking liquidity inflows/outflows, or analyzing user transaction patterns.
Micro Model Layer: A collection of models that predict specific outcomes, such as APY fluctuations, wallet activity, or asset volatility. These models are trained using both historical and real-time data.
Sub-Micro Models: These are specialized models that handle complex feature predictions, such as market sentiment analysis or the prediction of sudden volatility spikes in asset prices. They feed into the primary micro-models to enhance accuracy.
Micro-models for Web3 Personalization
The personalization layer's core functionality relies on a series of sophisticated micro models, each designed to predict distinct facets of user behavior, protocol performance, and asset characteristics. These models form the building blocks of our system, allowing for a highly modular and adaptable approach to personalization in Web3.
Time Series Prediction Models
Objective: To forecast temporal sequences of data points, such as protocol usage metrics, asset prices, or wallet transaction volumes.
Techniques: We employ models such as ARIMA, SARIMA, and more advanced methods like LSTMs (Long Short-Term Memory networks) and GRUs (Gated Recurrent Units). These models are crucial for predicting trends and cyclical patterns within the Web3 ecosystem.
Applications: Time series models are used to predict variables like future APY, asset price fluctuations, and user engagement trends.
Classification Models
Objective: To categorize data points into discrete classes based on learned features. These models are essential for tasks such as risk assessment, user segmentation, and behavior prediction.
Techniques: Common methods include Logistic Regression, Random Forests, Support Vector Machines (SVM), and Neural Networks. Advanced techniques like XGBoost and CatBoost are also employed for their superior performance in handling complex data structures.
Applications: Classification models are used for determining user risk profiles, categorizing protocols based on security features, and identifying high-risk assets.
Regression Models
Objective: To predict continuous outcomes based on a set of input features. These models are vital for understanding relationships between variables and for making quantitative predictions.
Techniques: Linear Regression, Ridge and Lasso Regression, and advanced methods like Gradient Boosting and Bayesian Regression are used. Deep learning models such as Feedforward Neural Networks are also applied where nonlinear relationships are prominent.
Applications: Regression models predict metrics like protocol TVL (Total Value Locked), user transaction volumes, and future liquidity inflows.
Clustering Models
Objective: To group similar data points together based on their features. Clustering models are particularly useful for uncovering hidden patterns and segmenting the Web3 ecosystem into meaningful groups.
Techniques: Techniques such as K-Means, Hierarchical Clustering, DBSCAN, and Gaussian Mixture Models (GMMs) are utilized. These models are non-supervised and help in discovering natural groupings within the data.
Applications: Clustering models are used to segment users, categorize assets based on risk profiles, and identify communities within DAOs.
Anomaly Detection Models
Objective: To identify outliers or abnormal patterns in the data that could indicate fraud, security breaches, or other forms of risk.
Techniques: Isolation Forests, One-Class SVM, Autoencoders, and statistical methods like Z-Score analysis are applied. These models are critical for maintaining the integrity of the personalization layer by flagging unusual activity.
Applications: Anomaly detection models monitor wallet transactions for fraudulent activity, detect unusual protocol behaviors, and identify sudden shifts in asset prices.
Each micro model undergoes a rigorous training process, where the objective is to optimize for accuracy, generalization, and computational efficiency. Key considerations include:
Hyperparameter Tuning: Using techniques such as Grid Search and Random Search to identify the optimal model parameters.
Cross-Validation: Employing K-Fold Cross-Validation to ensure that models generalize well across different subsets of data.
Regularization: Applying techniques like L1 (Lasso) and L2 (Ridge) regularization to prevent overfitting, ensuring that models remain robust and scalable.
Sub-micro models enhance the predictive power of primary micro models by providing more granular insights. For instance, a sub-micro model predicting asset volatility may feed its output into a broader model tasked with predicting liquidity flows. This hierarchical approach allows for more accurate and nuanced predictions, which are essential for delivering personalized recommendations across Web3.
Once the micro-prediction models have been validated, the next step is to fuse them into an ensemble model. This ensemble will serve as the backbone for vectorizing entities within the ecosystem.
Weighted Averaging: Combines model outputs based on the relevance and accuracy of each model.
Stacking: Uses a meta-model to combine the outputs of base models, improving overall prediction performance.
Boosting: Sequentially applies models, where each new model corrects errors made by the previous one.
Generate vector representations for each entity, enabling multi-dimensional analysis and matching.
Allow users and developers to customize which prediction parameters are included in the vector, providing flexibility for different use cases.
Lucidity’s personalization layer is designed to be highly modular, allowing developers to build customized matching engines that cater to specific needs. By selecting from a library of micro models, developers can create engines tailored to various Web3 applications.
Examples of Custom Matching Engines:
Investment Portfolio Engine: Combines predictions from asset volatility, market sentiment, and user risk tolerance models to recommend a personalized investment portfolio.
Community Engagement Engine: Uses models that predict user behaviour and community sentiment to suggest DAOs or projects where a user is likely to be most engaged.
The matching engine uses algorithms such as collaborative filtering, cosine similarity, or reinforcement learning to match users with the most suitable protocols, assets, or communities based on their personalized profiles.
Example Implementation:
Collaborative Filtering: Matches users with similar profiles to suggest protocols or assets that they might not have discovered yet but are popular among similar users.
Reinforcement Learning: Continuously improves recommendations by learning from user feedback and interactions, ensuring that the engine adapts to changing user preferences and market conditions.
The personalization layer is designed to scale with the growth of Web3, incorporating new data sources, micro models, and use cases as they emerge. Whether for emerging DeFi protocols, new NFT marketplaces, or upcoming decentralized social platforms, the system can adapt to provide personalized experiences.
